Summary:arXiv introduces the Counterfactual Neighborhood Risk Fields (CNRF) framework, a novel approach to enhancing the safety defenses of vision-language models (VLMs). CNRF constructs context-matched benign-harmful counterfactual pairs, uses their representation differences as capability-related risk directions, and estimates neighborhood support separately from risk. This separation prevents conflating unfamiliarity with harmfulness, enabling selective intervention rather than blanket rejection. In

1. Background and Motivation

Vision-language models (VLMs) face significant safety challenges when processing multimodal data, such as the identification and defense against harmful inputs. Traditional representation-based safety defense methods often focus on separating harmful inputs from benign ones, but this separation alone does not explain what a risk score means or when it should be trusted.

2. Core Mechanisms of the CNRF Framework

The CNRF framework achieves more refined safety defense through the following steps:

  1. Constructing Counterfactual Pairs: Creating context-matched benign-harmful input pairs.
  2. Extracting Risk Directions: Using the representation differences between these pairs as capability-related risk directions.
  3. Estimating Neighborhood Support Independently: Separating neighborhood support from risk estimation to avoid conflating unfamiliarity with harmfulness.
  4. Selective Intervention: Utilizing a victim-adaptive interface to route selected requests for same-victim response review based on different VLMs' safety observations, thereby releasing acceptable candidates or generating constrained alternatives with reduced harmful capability.

3. Experimental Results and Performance

In tests across three VLMs and five multimodal jailbreak families, the CNRF framework demonstrated strong performance:

  • Defense Success Rate: Achieved a macro defense success rate of 86.06%-89.30%.
  • Benign Task Utility: Maintained substantial benign-task utility while achieving high defense rates.

Furthermore, experiments showed that query-matched references and preserved context-answer correspondence significantly improved risk ranking accuracy in the low-false-positive regime.

4. Technical Innovations and Advantages

  • Counterfactual Analysis: By constructing counterfactual pairs, CNRF can more accurately identify risk directions.
  • Selective Intervention: Avoids blanket rejection of all inputs, enabling more refined safety control.
  • Victim-Adaptive Interface: Adapts to different VLMs' safety observations, enhancing the framework's versatility.

5. Future Outlook

The CNRF framework offers a new approach to VLM safety defense and can be extended to other types of AI models and application scenarios. Additionally, CNRF's mechanisms can be combined with other safety technologies to provide even stronger defense capabilities.
