Summary:A new arXiv study proposes using large language models to automate the construction of baselines for deep learning research. The method aims to address the issue of pseudo-progress in studies due to missing or inadequate baselines. In 36 scientific tasks, the automatically constructed baselines recovered a median of 95.5% of the performance gap between a trivial predictor and the deep learning model, with 12 studies showing baselines outperforming the deep learning models. Background and Motivation

In recent years, deep learning has seen increasing applications in the physical and life sciences. However, many studies struggle to accurately assess their progress due to the lack of appropriate baselines, leading to cases where apparent advancements are actually pseudo-progress. To address this issue, the arXiv research team proposes a method that uses large language models to automate the construction of baselines.

Methodology and Implementation

The team assembled 36 supervised classification and regression tasks from peer-reviewed studies in leading scientific journals such as Nature, Science, and Cell-family journals. They then used a language model to construct simple baselines for each task, capturing the core features and structure of the tasks to generate competitive predictions.

Results and Analysis

The experiments showed that the automatically constructed baselines recovered a median of 95.5% of the performance gap between a trivial predictor and the deep learning model, with an average of 85.7%. In 12 studies, the baselines even outperformed the deep learning models. The study also analyzed the variation in baseline performance across different scientific domains and publication venues, and examined the effects of test-time compute and access to different levels of study context.

Discussion and Impact

This research demonstrates the potential of automated baseline construction in enhancing the rigor of deep learning research. As the volume of research articles continues to grow rapidly, human peer review struggles to keep up. Automated baseline construction offers a scalable evaluation method to ensure the reliability and validity of deep learning studies.

Future Directions

The research team plans to further optimize the baseline construction method and explore its applications in more scientific domains. Additionally, automated baseline construction can be integrated with existing automated review systems to provide a more comprehensive evaluation framework for deep learning research.
