Summary:arXiv introduces the concept of Forward-Backward Markov Decision Processes (FB-MDPs) and proposes the Forward-Backward Multi-Objective Actor Critic (FB-MOAC) algorithm to address multi-objective optimization problems involving both forward and backward dynamics. This novel approach adapts reinforcement learning (RL) algorithms to FB-MDPs through a general forward-backward stepwise template, ensuring guaranteed convergence and competitive performance compared to standard RL approaches. Evaluation

1. Introduction

Reinforcement Learning (RL) algorithms excel in solving problems that can be modeled as Markov Decision Processes (MDPs). However, many real-world problems involve both forward and backward dynamics, such as those in stochastic control and network systems. These problems cannot be expressed as standard MDPs, necessitating a new theoretical framework to address this challenge.

2. The Concept and Theoretical Framework of FB-MDPs

This study introduces the concept of Forward-Backward MDPs (FB-MDPs) for multi-objective optimization problems. FB-MDPs can handle both forward and backward dynamics, and a new theoretical framework is developed to characterize their optimal solutions.

3. The FB-MOAC Algorithm

Based on the above framework, we propose the Forward-Backward Multi-Objective Actor Critic (FB-MOAC) algorithm. This algorithm employs a stepwise optimization template to adapt to the characteristics of FB-MDP problems and ensures convergence. Compared to standard RL methods, FB-MOAC demonstrates superior performance across multiple metrics.

4. Experiments and Results

FB-MOAC was evaluated in various scenarios, including mathematical finance and mobile resource management. The results show that FB-MOAC outperforms existing methods in the following aspects:

  • Convergence Speed: FB-MOAC converges faster, finding optimal solutions more quickly.
  • Reward Maximization: FB-MOAC better maximizes rewards, effectively balancing multiple objectives.
  • Robustness: FB-MOAC exhibits higher robustness when dealing with complex dynamics.

5. Conclusion and Future Work

FB-MOAC provides an effective solution for Forward-Backward MDPs, demonstrating its potential in multi-objective optimization problems. Future research directions include further optimizing the algorithm's performance and applying it to more real-world scenarios.

Engineering Trade-offs and Practical Deployment Recommendations

  • Computational Overhead: FB-MOAC may require significant computational resources when dealing with complex problems, so it should be used with caution in resource-constrained environments.
  • Model Complexity: The model complexity of FB-MOAC is high, which may lead to longer training times.
  • Application Scenarios: FB-MOAC is suitable for scenarios that require handling both forward and backward dynamics, such as financial risk management, supply chain optimization, and intelligent transportation systems.
