Summary:arXiv introduces CA-MOPD (Capability-Aware Multi-Teacher On-Policy Distillation), a novel framework addressing the challenge of uneven supervision in multi-teacher policy distillation. By merging reinforcement learning specialists and using verifier-estimated capability gaps to adjust domain-level distillation strength, CA-MOPD ensures that supervision decreases as the student’s capability improves, preventing unnecessary strong supervision. Across six benchmarks spanning mathematics, code gener

Background and Motivation

In reinforcement learning (RL), Multi-Teacher On-Policy Distillation (MOPD) enhances student agent performance by integrating knowledge from multiple domain experts. However, existing methods struggle with determining the appropriate supervision strength: even when the student matches or exceeds the teacher's performance, they may still receive strong supervision, as behavioral mismatch does not necessarily indicate a remaining capability deficit.

CA-MOPD Framework

CA-MOPD (Capability-Aware Multi-Teacher On-Policy Distillation) addresses these challenges through the following mechanisms:

  1. Expert Merging and Initialization: It first merges multiple reinforcement learning experts into a robust student initialization model. This step aims to provide a solid knowledge foundation for the student.
  2. Capability-Gap Guided Allocation: A verifier estimates the capability gap between the teacher and the student, and the domain-level distillation strength is adjusted dynamically based on this gap. As the capability gap narrows, the supervision strength decreases; when the student’s capability regresses, the supervision strength increases.
  3. Dense Token-Level Guidance: Teachers continue to provide dense token-level guidance, ensuring the student learns from fine-grained feedback.

Experimental Results

In six benchmarks spanning mathematics, code generation, and instruction following, CA-MOPD achieves an average score of 32.22, outperforming the following methods:

  • Traditional MOPD (by 0.86 points)
  • Open-MOPD (by 0.83 points)
  • Merged Initialization (by 0.74 points)

Furthermore, under matched training budgets, the experimental results of CA-MOPD further support the advantages of expert merging and capability-gap guided allocation.

Technical Mechanism Analysis

  • Expert Merging Advantages: By merging multiple experts, CA-MOPD integrates knowledge from different domains, avoiding the limitations of a single expert.
  • Innovative Capability Gap Estimation: Using a verifier to estimate the capability gap, rather than relying on behavioral differences, makes the adjustment of supervision strength more precise.
  • Dynamic Adjustment Mechanism: The supervision strength changes dynamically based on the capability gap, ensuring that the student agent receives sufficient guidance while avoiding excessive supervision.

Engineering Trade-offs and Performance

  • Training Efficiency: CA-MOPD requires additional computational resources to estimate the capability gap, but the overall training efficiency is improved by reducing unnecessary supervision strength.
  • Model Performance: CA-MOPD performs excellently in multiple benchmarks, significantly enhancing the student agent's performance, especially in handling complex tasks.
  • Scalability: The method is applicable to models of different sizes and complexities, demonstrating good scalability.

Developer Implementation and Deployment Recommendations

  • Applicable Scenarios: CA-MOPD is suitable for reinforcement learning tasks that require the integration of multiple domain expert knowledge, such as robotics control, autonomous driving, and game AI.
  • Deployment Recommendations: It is recommended to deploy CA-MOPD in an environment with sufficient resources to fully utilize the advantages of its dynamic adjustment mechanism. Additionally, it is advised to fine-tune the model according to specific application scenarios to achieve optimal performance.
