Summary:Hugging Face introduces LeanPRM, a framework that leverages the Lean proof assistant to automatically generate step-level labels for natural language proofs, addressing a critical bottleneck in verifying AI-generated mathematical proofs. This approach eliminates the need for human annotations by using Lean to validate each step and filter out formal syntax errors, resulting in high-quality mathematical error labels. Background and Challenges

As AI systems become increasingly capable of generating mathematical proofs, verifying the validity of each step in these proofs has emerged as a new bottleneck. Existing methods rely on human annotations or derive labels from final answers, but these approaches are costly and unsuitable for open-ended proofs.

Core Mechanisms of LeanPRM

LeanPRM revolutionizes the verification process of AI-generated mathematical proofs through the following steps:

  1. Automated Label Generation: The model first generates a natural language proof along with a paired formal proof, without feedback from Lean.
  2. Step-Level Verification: Lean verifies each step and generates correctness labels.
  3. Error Filtering: A second model filters out failures caused only by formal syntax, ensuring that negative labels reflect mathematical errors rather than syntactic issues.

LeanPRM includes 10,634 proofs and 152K labeled steps, all without human intervention.

Experimental Results and Performance Improvements

On the LeanPRM-Bench benchmark, the Qwen3-4B verifier trained on LeanPRM increases the exact step-label accuracy from 48.2% to 74.7%, compared to 60.3% when the same base model is trained on PRM800K. Additionally, the LeanPRM-trained verifier performs better in best-of-N selection on IMO-level problems and outperforms the PRM800K-trained verifier on three out of four external verification benchmarks.

Engineering Trade-offs and Practical Applications

The strength of LeanPRM lies in its ability to generate high-quality mathematical error labels without human annotations, allowing it to scale with the supply of formal statements. However, its main challenge is the reliance on the Lean proof assistant, which may limit its application in non-formal proof scenarios. Moreover, the training process of LeanPRM requires substantial computational resources, especially when handling large proof sets.

For developers, LeanPRM provides an efficient tool for verifying AI-generated mathematical proofs and generating fine-grained error feedback. This is particularly valuable for applications requiring high reliability, such as automated theorem proving and mathematical education tools.

Future Directions

LeanPRM demonstrates the significant potential of AI in the field of mathematical proof verification. As more formal statements become available, LeanPRM can further expand its coverage and may be combined with other AI technologies to tackle more complex verification tasks.
