Summary:Hugging Face has released a study on the psychometric audit of decision models used as synthetic survey respondents. The research tested 14 decision models and 47 generative language models (LLMs) using the Psychometric Similarity Score (PSS) to evaluate their ability to replace human respondents. The results indicate that while some generative models perform well, decision models show significant limitations in prediction accuracy and pattern reproduction. The study emphasizes the importance of

Background and Motivation

In recent years, language models have been widely used to create synthetic survey samples, also known as silicon samples. Decision models, a new class of language models, output probabilities for each point on a rating scale instead of text. This study aims to evaluate whether these decision models and the latest generative large language models (LLMs) can replace human respondents in psychometric surveys.

Methodology

The research team tested 14 decision models from 11 providers and 47 generative LLMs using an open Lithuanian organizational-psychology survey (n=263, 68 items) as the benchmark. The evaluation was conducted with 100 real respondent profiles, the Psychometric Similarity Score (PSS), and statistical baselines.

Key Findings

  1. Generative Model Performance: The best-performing generative model, MiniMax M3, achieved a PSS score of 0.813, which is close to the Gaussian copula fit on other respondents (0.824) but below the in-sample copula fit (0.927).

  2. Decision Model Limitations: Among the 10 product lines, 5 of the latest generative releases scored lower than earlier versions beyond resampling noise, and none gained beyond it. With the default rounded readout, 13 out of 14 decision models scored below the reference model gpt-5.4-mini.

  3. Pattern Reproduction: 33 out of 47 generative models reproduced the pattern of item correlations better than any decision model.

  4. Prediction Accuracy: Every decision model performed worse than the answer frequencies of other respondents as forecasts of each person's own answers, mainly because its average vector differed from them.

Conclusion and Recommendations

The study concludes that while generative models show promise in certain aspects, decision models have significant limitations in simulating human behavior, particularly in terms of prediction accuracy and pattern reproduction. The researchers recommend that decision models should focus more on sample-level fidelity rather than just individual prediction accuracy. Additionally, the study suggests that future model development should aim to bridge the gap between model outputs and real human behavior.

Implications for Developers and Researchers

  • Model Selection: When high-fidelity simulation of human behavior is required, generative models should be prioritized over decision models.
  • Evaluation Metrics: When evaluating model performance, multiple dimensions such as PSS score, pattern reproduction ability, and prediction accuracy should be considered.
  • Continuous Improvement: Developers should focus on improving the sample-level fidelity of models and explore new training methods to enhance the simulation of human behavior.
