Background and Challenges

In enterprise data management, entity alignment is crucial for ensuring consistency across different data sources. Traditional manual matching methods are not scalable, while LLM-only matching methods, although improving semantic recall, often violate structural and physical invariants, leading to invalid correspondences.

Constraint-Guided Mapping (CGM) Method

The ArXiv team proposes CGM, a novel neuro-symbolic approach that addresses these challenges through a three-stage process:

  1. Schema-grounded admissibility constraints: Uses metadata to define constraint types and execute relational normalization logic.
  2. Constraint-restricted candidate generation: Employs cascade relaxation to ensure a non-empty feasible set under noise.
  3. Neural ranking with bounded LLM disambiguation: Performs neural ranking within the feasible set using bounded LLM disambiguation.

Advantages of the Method

  • Model Independence: CGM's advantages are not tied to a specific model configuration and can be transferred across multiple enterprise datasets.
  • Efficiency Improvement: Achieves significant cost reduction while maintaining high accuracy. Compared to frontier LLMs without constraints, CGM reduces costs by approximately 28 times.
  • Reduced Expert Workload: By automatically discovering and allowing expert-refinable constraints, CGM reduces expert workload by about 7 times.

Experimental Results

In a controlled structural-decoy benchmark, hard admissibility constraints reduced the candidate space by about 480 times without dropping the ground truth. Layer-by-layer ablation experiments show that the constraint, not the LLM, is the decisive factor for performance improvement. The macro F1 score on seven enterprise datasets reaches 0.70, demonstrating CGM's wide applicability and high performance.

Industry Impact

CGM provides enterprises with an efficient, scalable, and cost-effective solution for handling complex entity alignment tasks. Its ability to reduce expert workload and improve semantic matching accuracy makes it a significant breakthrough in the field of enterprise data management.

Developer Recommendations

  • Application Scenarios: Suitable for enterprise data alignment tasks that involve semi-structured data, implicit attributes, and mismatches in units and granularity.
  • Model Selection: It is recommended to choose appropriate constraint types and LLM models based on specific task requirements.
  • Optimization Strategies: Combine domain knowledge to optimize constraint conditions for further improvement in alignment accuracy.
