Summary:Hugging Face has introduced Self-Credit, a novel reinforcement learning approach designed to address the challenge of credit assignment in long-horizon agentic tasks with sparse rewards. By generating dense supervision signals from sparse outcome rewards through self-generated credit and intra-group rescaling, Self-Credit significantly enhances the performance of agents in complex tasks. Benchmarks on BrowseComp-Plus, GAIA, and xBench-DeepSearch demonstrate that Self-Credit outperforms both base

Technical Mechanism Analysis

Self-Credit is a reinforcement learning method tailored for long-horizon agentic tasks, addressing the challenge of credit assignment due to sparse rewards in traditional RL approaches. Its core mechanism consists of three key components:

  1. Self-Generated Credit Assignment: During the rollout of the policy model, the model generates summaries that cite earlier turns containing critical evidence. These summaries serve as self-generated credit signals, forming the basis for subsequent credit assignment.

  2. Intra-Group Rescaling: By comparing cited actions across successful and failed rollouts for the same prompt, Self-Credit uses group-level agreement and disagreement to remove undeserved credit and further emphasize credit assigned to critical actions. This approach leverages collective consensus to optimize credit allocation.

  3. Advantage Reweighting: The rescaled credit weights are used to update the advantages of the cited turns, enabling more precise policy optimization.

Engineering Trade-offs and Performance

Self-Credit demonstrates strong performance across multiple benchmarks:

  • On BrowseComp-Plus, Self-Credit improves over Qwen3 8B and 32B baseline models by 37.0 and 36.2 percentage points, respectively, and outperforms the strongest agentic RL baselines by 8.5 and 5.6 percentage points.
  • On GAIA and xBench-DeepSearch, Self-Credit also achieves improvements of 4.9 and 4.7 percentage points, respectively.

Analyses show that self-generated credit provides useful signals for selecting critical actions, and that intra-group rescaling, especially on failed rollouts, is crucial and effective across different model scales.

Developer Deployment and Implementation Recommendations

The innovation of Self-Credit lies in its ability to transform sparse rewards into dense supervision signals, which is particularly valuable for training agents in long-horizon tasks. Developers can apply Self-Credit in the following scenarios:

  • Complex Task Training: In tasks that require long-term planning and multi-step decision-making, Self-Credit can significantly enhance the learning efficiency and final performance of agents.
  • Resource-Constrained Environments: Due to its efficient self-generated credit mechanism, Self-Credit performs well even in resource-constrained environments.

It is recommended that developers fine-tune the model according to specific task requirements to fully leverage the advantages of Self-Credit.
